Story Framework: Pushing Back on a RAG Support Agent Launch with a Four-Quadrant Error Analysis
AI Engineer behavioral interviews love asking "tell me about a time you held the line under timeline pressure," and evaluation is exactly the step that gets compressed first in LLM products — because a single overall accuracy number looks clean, even when it hides the most expensive class of errors. Here's a version you can adapt directly, or use as a template for your own real experience.
Situation: My team was moving a RAG support agent for an internal engineering knowledge base from limited testing to a company-wide launch. The PM had already committed externally to "launching in two weeks, replacing most of the questions in the #ask-infra Slack channel."
Task: I owned the agent's retrieval/generation pipeline and was asked to produce an evaluation report proving it was accurate enough to ship, before launch.
Action: I started with the most common approach — randomly sampling 50 questions and manually checking whether the answers were correct, which gave 82% overall accuracy and looked like a pass. But I realized this single number didn't separate "was retrieval correct" from "was the answer correct," and didn't look at the distribution of failure cases. I re-labeled the 50 questions into four quadrants (retrieval correct/incorrect × answer correct/incorrect) and found that "retrieval correct but answer wrong" accounted for nearly half of all errors — the root cause was that old and new API versions were mixed in the same batch of retrieved chunks, and the generation step frequently picked the wrong version. I brought this finding directly to the PM: launching on the original evaluation would expose users not to low-risk "no answer found" failures, but to the most trust-damaging kind — an answer that reads as correct while citing an outdated version of the docs. I proposed splitting the launch into two phases: run shadow mode in #ask-infra for two weeks to collect real questions, while adding a "version conflict detection" rule — whenever retrieval returned chunks tagged with multiple versions, generation had to explicitly cite the version and add a caveat instead of answering directly. The PM initially resisted delaying, so instead of just saying "I don't think it's accurate enough," I backed the ask with the four-quadrant error distribution data, and proposed delaying by only one week rather than redoing the whole evaluation.
Result: Shadow mode caught 23 version-conflict cases within two weeks; after adding the detection rule, version-conflict errors dropped to near zero. In the post-launch satisfaction survey, the share of users saying "this answer made me trust it less, not save me time" dropped from 18% in the pre-launch shadow-mode baseline to 4% after launch. A month after launch, #ask-infra channel question volume dropped 35%, hitting the PM's original target — just one week later than planned. After this, we made "separate retrieval/generation evaluation" plus "version conflict detection" a standard pre-launch checklist item for every internal RAG project since.
If I had only reported the single number "82% overall accuracy" at the start, the short-term difference would have been invisible — but the trust crisis that would have followed launch would have cost far more than a one-week delay. That's now my working principle for evaluating any ML/LLM system: a single aggregate metric almost always hides the most expensive category of error.
How to Tell This Story
- Do: Lead with how you discovered that "overall accuracy" was a misleading metric, rather than jumping straight to how good you are at evaluation — this is more convincing than the generic "I ran an A/B test" answer, and closer to the diagnostic process interviewers actually want to hear.
- Do: Anchor every turn in the story with a concrete number (23 cases, 18% → 4%, 35%) instead of vague phrases like "things improved" — even one hard number is more credible than a paragraph of adjectives.
- Do: Close by turning this one incident into a standing process for every subsequent project — this shows you can convert a single case into systemic improvement, not just resolve the immediate crisis.
- Don't: Don't frame the PM's initial pushback as an obstacle to be defeated — interviewers care about how you persuade with evidence, not how well you fight authority; casting the other person as an antagonist just signals you're hard to work with.
- Don't: Don't skip the part where you prove a one-week delay is enough, rather than a full redo — that's exactly the negotiation detail interviewers want to hear. Skip it, and the story reads as "I said no" without explaining how you actually got to yes.
